At one level I want to say: perhaps Probability Theory The Logic of Science is really where everyone should start.
But from a practical perspective Statistical Rethinking by McElreath is what you get when McElreath reads PTTLOS and tries to teach that... so maybe start there...
Stats is not really a math course, and the most important components of statistics are really building models
